Data Source

This dataset includes customer transaction data from a fictitious SaaS company selling software B2B. The dataset includes columns such as Order ID, Order Date, Customer ID, Product, Sales, and Profit.

"How effective have recent customer acquisition and engagement strategies been in increasing Customer Lifetime Value (CLV), and what impact do cohort-specific factors, such as promotions and market conditions, have on the financial performance of different customer segments over time?"

Methodology

This project conducts a detailed cohort analysis, segmented by first purchase dates and hypothesized product usage groups, to derive actionable insights into customer engagement, retention, and revenue generation. Customer segmentation allows us to categorize customers into distinct groups based on their purchasing behavior and product usage, enabling a more tailored analysis of trends and patterns within each segment.

Cohort analysis is employed as it tracks the performance of these customer segments over time, making it the most effective method to understand how different strategies impact long-term customer value and to identify the factors influencing retention and revenue. This approach is crucial for answering the business question, as it reveals both immediate and evolving customer behaviors that drive profitability.

The analysis focuses on the following key metrics:

  • Customer Retention Rate (CRR): Measures the percentage of customers within each cohort who continue making purchases over subsequent periods, providing insights into customer loyalty and the effectiveness of retention strategies.
  • Net Revenue Retention (NRR): Evaluates the percentage of recurring revenue retained from existing customers over a specified period, accounting for upsells, downsells, and churn, offering a comprehensive view of revenue stability and growth.
  • Customer Lifetime Revenue (CLR): Calculates the total revenue generated by a customer throughout their relationship with the business, helping to identify high-value customer segments.
  • Customer Lifetime Value (CLV): Estimates the total profit expected from a customer over their entire relationship with the business, guiding strategic decisions on customer acquisition and retention investments.

Process

  1. Data and Libraries Import and Loading: Imported necessary Python libraries, including pandas, numpy, seaborn, and matplotlib. Loaded the dataset containing customer transactions and product details, ensuring all relevant columns were correctly parsed and formatted for analysis.
  2. Exploratory Data Analysis (EDA): Conducted an initial exploration of the dataset to understand its structure, identify missing values, and detect any anomalies. Generated descriptive statistics and visualizations to gain insights into customer behavior, product performance, and overall sales trends.
  3. Customer Segmentation: Defined products and their respective definitions based on hypothesized usage groups. Segmented the customer base into distinct groups according to these definitions, enabling more targeted analysis of product usage patterns and customer behaviors.
  4. Hypothesized Usage Group Validation: Validated the hypothesized usage groups through statistical analysis and visualization. Ensured that the segmentation accurately reflected distinct patterns in customer behavior, allowing for more meaningful cohort analysis.
  5. Cohort Analysis: Performed cohort analysis by calculating and analyzing key metrics such as Customer Retention Rate (CRR), Net Retention Rate (NRR), Customer Lifetime Revenue (CLR), and Customer Lifetime Value (CLV) both overall and within each usage group. Assessed CLR vs. CLV cost efficiency to determine the profitability of each cohort.
  6. Cohort Layer Cake: Created a cohort layer cake visualization to illustrate the cumulative CLV over time, both overall and for each usage group. This visualization helped identify patterns in customer value contribution across different cohorts and highlighted the impact of specific customer acquisition and retention strategies.
  7. Business Question Specific Insights and Recommendations: Synthesized findings from the EDA, cohort analysis, and cohort layer cake into a cohesive set of results to answer the business question.
